You must request a page twice to get a URL cached.
But when I checked on Google Page Speed Insights or Lighthouse.

1.) You don’t use all settings for page optimization.
2.) You have a huge number of external requests for ads and analytics
3.) Bad coded theme
-> 2.) This is the main reason why you get bad score. You can’t get both. Either a fast loading page or earning money with ads, but not all at the same time. Neither a fastest cache nor the best plugin for page optimization can fix that.

2. There are only 2 ads on the website [one is on the sidebar, and in the posts]. But I removed those also.

It’s up to you to set more settings.

The number of ads doesn’t matter. 1 ad is enough to force a high number of external requests and these external requests blocks page rendering.

Not at all.
Anyway, the reason for bad score is selfmade and can’t be fixed by page optimization. Remove ads and analytics and your page will fly.
